This is despite the fact that I have it set as borderless window. So each time I open the client I have to set it to windowed mode then back to borderless.

Webyes, and this is what I do: put it into regular windowed mode. Once you have it there, switch it over to the display that you want and make it fullscreen. Once you have accepted fullscreen mode, open the graphics again and select borderless fullscreen. It seems stupid that it won't let you do it another way, but that's just how it goes I guess.
